 $$ \mathbf{q}(\mathbf{x}_{t}|\mathbf{x}_{t-1})=\mathcal{N}(\mathbf{x}_{t};\sqrt{1-\beta_{t}}\mathbf{x}_{t-1},\beta_{t}\mathbf{I}), $$

 $$ \alpha_{t}=\prod_{t=1}^{T}(1-\beta_{t}), $$

 $$ \mathbf{q}(\mathbf{x}_{t}|\mathbf{x}_{0})=\mathcal{N}(\mathbf{x}_{t};\sqrt{\alpha_{t}}\mathbf{x}_{t-1},(1-\alpha_{t})\mathbf{I}), $$

<div style="text-align: center;">Figure 1. Training procedure of the proposed diffusion-based 2D-to-3D human pose estimation lifting. DiffHPE-Wrapper is composed of a frozen pre-trained lifting backbone $h_*$, a linear encoding layer $w_\theta$ for the 3D data, and noise-predicting deep neural network $\epsilon_\theta$. More details in subsections 3.2 and 3.4. 'Forward diffusion' corresponds to equation (3) and 'concat' to channel-wise concatenation.</div>

 $$ \mathrm{p}(\mathbf{x}_{t-1}|\mathbf{x}_{t})\approx\mathcal{N}(\mathbf{x}_{t-1};\mu_{\theta}(\mathbf{x}_{t},t),\Sigma_{t}), $$

 $$ \mu_{\theta}(\mathbf{x}_{t},t)=k_{1,t}(\mathbf{x}_{t}-k_{2,t}\epsilon_{\theta}(\mathbf{x}_{t},t)), $$

 $$ \mathrm{p}(\mathbf{x}_{t-1}|\mathbf{x}_{t},c)\approx\mathcal{N}(\mathbf{x}_{t-1};\mu_{\theta}(\mathbf{x}_{t},c,t),\Sigma_{t}), $$

 $$ \mu_{\theta}(\mathbf{x}_{t},c,t)=k_{1,t}(\mathbf{x}_{t}-k_{2,t}\epsilon_{\theta}(\mathbf{x}_{t},c,t)), $$

我们假设在长度为L的帧序列中可获取2D和3D姿态，每个帧包含J个关节，满足$\mathbf{x}^{\mathrm{2D}} \in (\{1, \ldots, h\} \times \{1, \ldots, w\})^{L \times J} \subset \mathbb{R}^{L \times J \times 2}$和$\mathbf{x}^{\mathrm{3D}} \in \mathbb{R}^{L \times J \times 3}$。

 $$ \mathrm{p}(\mathbf{x}_{T}^{\mathrm{3D}}|\mathbf{x}^{\mathrm{2D}})=\mathcal{N}(\mathbf{x}_{T}^{\mathrm{3D}};0,\mathbf{I}), $$

 $$ \begin{array}{r}{\mathrm{p}(\mathbf{x}_{t-1}^{\mathrm{3D}}|\mathbf{x}_{t}^{\mathrm{3D}},\mathbf{x}^{\mathrm{2D}})\approx\mathcal{N}(\mathbf{x}_{t-1}^{\mathrm{3D}};\mu_{\theta}(\mathbf{x}_{t}^{\mathrm{3D}},\mathbf{x}^{\mathrm{2D}},t),\Sigma_{t}).}\end{array} $$

---

假设$f_* = g_* \circ h_*$是一个冻结的预训练提升神经网络，由骨干网络$h_* : \mathbb{R}^{L \times J \times 2} \to \mathbb{R}^{L \times J \times C}$和线性回归输出头$g_* : \mathbb{R}^{L \times J \times C} \to \mathbb{R}^{L \times J \times 3}$组成。

 $$ \mathbf{E}^{\mathrm{2D}}=\mathrm{h}_{*}(\mathbf{x}^{\mathrm{2D}}),\mathbf{E}_{t}^{\mathrm{3D}}=\mathrm{w}_{\theta}(\mathbf{x}_{t}^{\mathrm{3D}}), $$

 $$ \begin{array}{r}{\mathrm{p}(\mathbf{x}_{t-1}^{\mathrm{3D}}|\mathbf{x}_{t}^{\mathrm{3D}},\mathbf{x}^{\mathrm{2D}})\approx\mathcal{N}(\mathbf{x}_{t-1}^{\mathrm{3D}};\boldsymbol{\mu}_{\theta}(\mathbf{E}_{t}^{\mathrm{3D}},\mathbf{E}^{\mathrm{2D}},t),\boldsymbol{\Sigma}_{t})}\end{array} $$

 $$ \mu_{\theta}(\mathbf{E}_{t}^{\mathrm{3D}},\mathbf{E}^{\mathrm{2D}},t)=k_{1,t}(\mathbf{x}_{t}^{\mathrm{3D}}-k_{2,t}\epsilon_{\theta}(\mathbf{E}_{t}^{\mathrm{3D}},\mathbf{E}^{\mathrm{2D}},t)) $$

![Image](images/e67f7c90282134af7d996de0c62225402a8f5b4beb3173e50e8d6fda4f89774f.jpg)

<div style="text-align: center;">Figure 2. Human pose lifting by diffusion on 3D pose, conditioned on 2D pose. Sampling is done by following the reverse process where the noise is estimated by the trained DiffHPE model.</div>

2. 采样得到$\varepsilon \in \mathbb{R}^{L \times J \times 3} \sim \mathcal{N}(0, \mathbf{I})$，并用它推导得到带噪声的3D数据$\mathbf{x}_t^{\mathrm{3D}};$

3. 计算$\mathbf{E}^{2\mathrm{D}} = \mathrm{h}_*\left(\mathbf{x}^{2\mathrm{D}}\right)$和$\mathbf{E}_t^{3\mathrm{D}} = \mathrm{w}_\theta\left(\mathbf{x}_t^{3\mathrm{D}}\right)$，并用它们预测噪声$\hat{\varepsilon} = \epsilon_\theta\left(\mathbf{E}_t^{3\mathrm{D}}, \mathbf{E}^{2\mathrm{D}}, t\right)$；

1. 采样得到$\mathbf{x}_T^{\mathrm{3D}} \in \mathbb{R}^{L \times J \times 3} \sim \mathcal{N}(0, \mathbf{I})$；

<div style="text-align: center;">Table 1. Training hyperparameters used in experiments. When possible, we used hyperparameters reported in [^41] for MixSTE, while the diffusion models' were tuned with random search.</div>

2. 计算得到$\mathbf{E}^{2\mathrm{D}} = \mathrm{h}_* (\mathbf{x}^{2\mathrm{D}})$；

(a) 计算$\mathbf{E}_t^{\mathrm{3D}} = \mathrm{w}_\theta(\mathbf{x}_t^{\mathrm{3D}})$，并用它预测噪声$\hat{\varepsilon}_t = \epsilon_\theta(\mathbf{E}_t^{\mathrm{3D}}, \mathbf{E}^{2\mathrm{D}}, t)$；

MixSTE† is verbatim from [^41], while MixSTE‡ is reproduced from the same official code, but without the hand-tuned weighted loss and test-time augmentation, for better comparison. #### 5.2.

<table border=1 style='margin: auto; word-wrap: break-word;'><tr><td style='text-align: center; word-wrap: break-word;'></td><td style='text-align: center; word-wrap: break-word;'>MixSTE[^41]</td><td colspan="2">DiffHPE-Wr.</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>With diffusion</td><td style='text-align: center; word-wrap: break-word;'>✗</td><td style='text-align: center; word-wrap: break-word;'>✓</td><td style='text-align: center; word-wrap: break-word;'>✓</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>Conditioning trained w/ occ.</td><td style='text-align: center; word-wrap: break-word;'>N/A</td><td style='text-align: center; word-wrap: break-word;'>✗</td><td style='text-align: center; word-wrap: break-word;'>✓</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>No occlusion</td><td style='text-align: center; word-wrap: break-word;'>54.8</td><td style='text-align: center; word-wrap: break-word;'>51.2</td><td style='text-align: center; word-wrap: break-word;'>51.2</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>Random</td><td style='text-align: center; word-wrap: break-word;'>54.5</td><td style='text-align: center; word-wrap: break-word;'>60.3</td><td style='text-align: center; word-wrap: break-word;'>53.2</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>Random leg and arm</td><td style='text-align: center; word-wrap: break-word;'>54.4</td><td style='text-align: center; word-wrap: break-word;'>55.2</td><td style='text-align: center; word-wrap: break-word;'>53.0</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>Consecutive leg</td><td style='text-align: center; word-wrap: break-word;'>55.1</td><td style='text-align: center; word-wrap: break-word;'>54.1</td><td style='text-align: center; word-wrap: break-word;'>52.6</td></tr><tr><td style='text-align: center; word-wrap: break-word;'>Consecutive frames</td><td style='text-align: center; word-wrap: break-word;'>55.8</td><td style='text-align: center; word-wrap: break-word;'>52.2</td><td style='text-align: center; word-wrap: break-word;'>53.5</td></tr></table>

 $$ \frac{1}{K L S_{left}}\sum_{i=1}^{K}\sum_{l=1}^{L}\sum_{s=1}^{S_{left}}\left|y_{i,l,s}-y_{i,l,\tau(s)}\right|, $$

 $$ \frac{1}{K S}\sum_{i=1}^{K}\sum_{s=1}^{S}\sqrt{\frac{1}{L}\sum_{l=1}^{L}(y_{i,l,s}-\bar{y}_{i,s})^{2}}, $$

其中 $\bar{y}_{i,s} = \frac{1}{L} \sum_{l=1}^{L} y_{i,l,s}$，S 为骨段的总数量。
