<div style="text-align: center;">Figure 3: The contextual reasoning (CR) module: The key (features extracted from the region of hand intersecting with object) is taken as context to enhance the query (object features). First, we compute a synergy map as the spatial similarity between query and key. Then we use this map for fusing the key into the query.</div>

 $$ \mathcal{F}_{i}^{o^{+}}=\sum_{j\in\Omega}w(i,j)\cdot V(\mathcal{F}_{j}^{h o})+\mathcal{F}_{i}^{o}\;, $$

---

$H \times W$。 $w(i,j)$的计算公式为

 $$ \begin{array}{r}{w(i,j)=\frac{\exp(q_{i}^{T}k_{j})}{\sum_{s\in\Omega}\exp(q_{i}^{T}k_{s})}\;,}\end{array} $$

2D关节定位网络的损失函数$\mathcal{L}_{\mathcal{H}}$是各关节j的真实热图$\mathcal{H}_j$与预测热图$\hat{\mathcal{H}}_j$之间的距离，即$\mathcal{L}_{\mathcal{H}} = \sum_{i \in N^h} \|\mathcal{H}_j - \hat{\mathcal{H}}_i\|_2^2$。

MANO模型将姿态参数$\theta \in \mathbb{R}^{48}$和形状参数$\beta \in \mathbb{R}^{10}$映射到手部网格顶点$\mathcal{V} \in \mathbb{R}^{778 \times 3}$以及3D关节$\mathcal{J}^{3D} \in \mathbb{R}^{N^h \times 3}$。

 $$ \mathcal{L}_{h a n d}=\lambda_{\mathcal{H}}\cdot\mathcal{L}_{\mathcal{H}}+\mathcal{L}_{\mathcal{M}}\;. $$

![Image](images/0d2094c83212df930b74a21f6eee273de235be561eca1337b54c2ed1cd063b31.jpg)

<div style="text-align: center;">Figure 4: Examples of hand mesh pseudo-labels generated from the video dataset [^14].</div>

第一条分支的损失函数是所有网格g和控制点i上的损失之和，记为$\mathcal{L}_{p2d} = \sum_g \sum_{i=1}^{N^o}||\delta_{g,i}||_1$。

第二条分支为每个网格g和控制点i回归一个置信度分数$c_{g,i}$，其中置信度的真实值$c_{g,i} = \exp(-||\delta_{g,i}||_2)$反映了预测结果与真实2D点位置的接近程度。测试时，我们会选取置信度最高的10个提议作为PnP算法的输入，以求解物体姿态。第二条分支的损失函数记为$\mathcal{L}_{conf} = \sum_{g} \sum_{i=1}^{N^o} ||\hat{c}_{g,i} - c_{g,i}||_2^2$，其中$c_{g,i}$和$\hat{c}_{g,i}$分别为真实值和预测值。

 $$ \mathcal{L}_{o b j e c t}=\lambda_{p}\cdot\mathcal{L}_{p2d}+\lambda_{c}\cdot\mathcal{L}_{c o n f}\;. $$

 $$ \Pi^{*}=\arg\operatorname*{m i n}_{\Pi}||\Pi\mathcal{J}^{3D}-\mathcal{J}^{2D}||_{2}^{2}, $$

![Image](images/161cc7335015f592b933ed37ac1a8bf87dd734273b2d75a463f7bba1daea2631.jpg)

<div style="text-align: center;">(a) Solve the camera projection by utilizing correspondence between estimated 3D hand joints and 2D hand joints. Then project the predicted 3D mesh to 2D.</div>

![Image](images/88f0a9d4b502a75c78f37aeb3725c1e12b2e3b96707a31b3d67b3ab782a06f52.jpg)

<div style="text-align: center;">(b) Leverage spatial-temporal consistency for pseudo-label selection. First apply spatial constraints in both 2D and 3D, then perform temporal filtering between consecutive frames.</div>

<div style="text-align: center;">Figure 5: Pipeline of pseudo-label selection for video frames in the wild.</div>

For each example, the first two columns show the recovered hand mesh and estimated 6-Dof object pose, the third row shows the estimated hand-object in 3D, the color of the object indicates the 3D object mesh error. Red indicated larger estimation error.</div>

 $$ \mathcal{L}=\mathcal{L}_{h a n d}+\mathcal{B}\cdot\mathcal{L}_{o b j e c t}\;. $$
